I'm a transitioning (from software testing to...) junior machine learning engineer who has gathered lots of experience with developing AI-powered solutions across multiple sectors, ranging from healthcare to finance, for roughly 3-4 years now, within and outside of academia.
While a model that pairs high generalizability with strong accuracy might be appealing, I draw value and confidence from different sources—all related to the way a solution comes together. For instance, a flawed development cycle brings about a model whose decision-making remains opaque. Similarly, an overoptimistic approach forces developers to sail through a sea of technical debt and wasted time just to find ideal hyperparameters, even though the underlying data remains garbage. Ultimately, a less knowledgeable project manager will lean toward adopting an AI-powered solution, even when readily available, less intricate, and far less expensive alternatives already exist. All these pitfalls I had encountered and found myself trapped in across the numerous projects (roughly 8) I implemented, all of which turned out successful after careful and mindful consideration of the implicit assumptions and givens.
Only then were culprits and setbacks uncovered. Only then did we discover how not realistic enough synthetic data might twist model performance to be high in both accuracy and false negatives and consequently lead us to believe that 8 out of 10 patients suffering from a severe illness actually shouldn't see the interior of a CT scanner. Only then did we discover that predicting balances of foreign branches is possible in theory but not applicable in practice due to improper handling of accounting maintenance. Only then did I figure out that a sound execution will lead to a flawless result, be it disappointing or encouraging.
